Creating structures with specific mechanical properties is a complex task. It requires knowing how design choices affect performance, especially when dealing with materials that can change shape under pressure. This becomes even more difficult when structures can deform in ways that are not straightforward. To improve this process, we are using a neural network, which is a type of artificial intelligence, designed to learn from previous experiments. By training this network on a large amount of data about how certain 3D-printed shells respond to compressive forces, we can understand the relationship between their design and performance. This allows us to create shells that can withstand specific pressures and deformations. We tested some of the designs that the network generated to see if they perform as expected.

The Challenge of Design

Additive Manufacturing, or 3D printing, provides the ability to create unique structures with customized features. These structures can be made to have different levels of stiffness and can absorb energy in different ways. However, achieving the desired mechanical behavior for these structures, particularly those that undergo significant changes, requires a deep understanding of how various design factors affect performance.

Typically, designers go through a lengthy process of making changes, testing the results, and starting over if they don’t achieve what they want.   2. Inverse design: This identifies designs that will achieve a desired performance.

Using Neural Networks for Design

The GCS are made with specific parameters that control their shape and behavior. For example, some parameters define the height, mass, and wall thickness of the shells. Each of these aspects plays a vital role in how the shell will react under compression.

Data Processing

To prepare our dataset for analysis, we went through several steps to clean and structure the data. This included standardizing the performance metrics extracted from the force-displacement curves to make them more manageable for our predictions.

We used a method called Principal Component Analysis (PCA) to reduce the complexity of the data while still capturing essential features. By transforming the force measurements into principal components, we could focus on the most important aspects of the performance without losing significant information.

We also ensured that the materials used in the shells conformed to realistic parameters. For instance, we categorized materials with one-hot encoding and normalized other parameters to keep them within defined ranges.

Neural Network Architecture

To make accurate predictions, the TNN must effectively learn the complex relationships between design and performance. The forward design network creates a mapping from design parameters to performance outcomes, while the inverse design network does the opposite.

The TNN uses multiple layers of processing to learn effectively, allowing it to handle the challenging task of mapping between different designs and their associated performances. To ensure we obtain realistic and useful outputs, we also apply specific activation functions that help refine the predictions.

The objective of the training process is to minimize the errors between predicted and actual performances. By focusing on the most informative aspects of our data and ensuring the generated designs are realistic, we can achieve better accuracy in the predictions made by our neural network.

Training and Evaluation

Our training involved splitting the dataset into different parts, allowing us to train, validate, and test the TNN. The two-stage training process ensures that each part of the network learns effectively.

We used an advanced optimization process during training, which allows the network to improve continuously based on feedback from the data. Initial experiments showed that we could reach effective predictions within a relatively short time, demonstrating the efficiency of the TNN.

Once trained, we evaluated the network by comparing the predicted performance of the designs to actual test cases. This evaluation showed that our method could predict key metrics such as stiffness, work, and maximum deformation with high accuracy.

Testing Generated Designs

To verify the capabilities of our TNN, we fabricated several generated designs and performed compression tests to see how well they matched the predicted outcomes. This step is crucial for validating the effectiveness of the TNN in real-world applications.

In addition to generating designs that perform well under pressure, we also evaluated their printability. Ensuring that the shell designs could be manufactured without issues is essential for practical use.

Applications of the TNN

Our TNN can be used for various real-world applications. For example, we tested its ability to create impact-absorbing structures, which can be critical for protecting fragile items during drops. By optimizing the design to meet specific energy absorption targets, we were able to develop solutions that worked effectively in this test case.

Additionally, we explored the option of emulating the mechanical properties of other materials. This capability allows users to create customized designs suitable for specific functional needs while optimizing for factors like cost and production time.

The use of our TNN for the design of 3D-printed shells represents a significant step forward in bridging the gap between design and material performance. By effectively learning from experimental data, we can create structures that meet specific mechanical requirements, whether they are for cushioning impacts or emulating other materials.

As we continue to refine this approach, we look forward to exploring how to enhance user control over design parameters and improve performance predictions. Our work opens up many exciting possibilities for future research, particularly in how experimental data and simulations can work together to create more effective design solutions.
