In many fields, including medical imaging and photography, we often work with images that are not clear. These images are usually versions of a clearer original image that have been changed by blurring and noise. The primary goal in these situations is to take the blurred image and recover the original, clearer image.

Image blurring can generally be explained by a process known as convolution, which is a way to combine two sets of information. When we try to recover the clearer image from the blurred version, we are facing an inverse problem. This means we are trying to find the original image based on the distorted one, which can be tricky.

To tackle this challenge, we often use a method called regularization. This is a technique that helps stabilize the solution to our problem by introducing additional information or constraints. In our case, we use a specific kind of regularization called Total Variation (TV) regularization. This leads to a situation where we want to recover the original “true image” from this distorted version. The process can be viewed mathematically, where we represent the blurred image as a combination of the original image and some noise.

The challenge in recovering the original image stems from the ill-posed nature of the problem, meaning that small changes in the input (the blurred image) can lead to large changes in the output (the recovered image). To address this, we typically apply regularization techniques, and in our case, we choose total variation regularization. However, our interest goes beyond just finding a possible solution; we also want to quantify the uncertainty related to our reconstruction. By framing the problem within a Bayesian context, we can express this uncertainty in a systematic way. The Posterior Distribution we derive is complex and cannot be easily computed directly. Thus, we resort to using MCMC methods to sample from this distribution. Therefore, we propose a strategy that utilizes the sparse structure of the posterior distribution, which allows us to perform more efficient sampling.

Bayesian Approach

In Bayesian inference, we work with a model that reflects our beliefs about the unknown original image before observing any data. This model is known as the prior distribution. Once we obtain the blurred image, we can combine this prior with the likelihood of the observed data to form the posterior distribution.

The likelihood describes how probable the observed data (the blurred image) is, given different possible original images. The posterior distribution is the key focus, as it reflects our updated beliefs about the original image after taking the data into account.

When we define our prior based on total variation, we ensure that the recovered image will have smooth transitions and preserved edges. This is particularly useful because most natural images exhibit these properties.

To sample from the posterior distribution effectively, we introduce the MALA-within-Gibbs (MLwG) method. This technique combines the ideas of the Gibbs sampler with a proposal distribution derived from the Metropolis-adjusted Langevin algorithm (MALA).

MALA is a method that uses the gradient of the target distribution to propose new samples. However, in cases where our target distribution is not smooth, applying MALA directly can be problematic. To address this, we smooth the potential function associated with our total variation prior, allowing us to use MALA effectively.

The smoothing ensures that the errors introduced by this approximation are systematically distributed, preventing localized artifacts in the reconstructed image. As a result, we can still maintain a high level of integrity in our recovered images.

In our MLwG method, we partition the image into smaller blocks, allowing for parallel updates of these blocks. This approach helps to manage the complexity of high-dimensional data by reducing the problem's dimensionality during sampling.

Given the local dependencies in the posterior distribution, we can efficiently update blocks of pixels without requiring knowledge about distant pixels. This locality simplifies computations and improves overall sampling performance.

Numerical Experiments

To validate our approach, we perform several numerical experiments. We use standard images and simulate blurring and noise to create degraded versions of these images. Our goal is to apply the MLwG algorithm to recover the original images and assess the quality of our reconstructions.

Image Reconstruction

The first experiment involves a grayscale image of a “cameraman.” We generate a blurred version of this image by applying a Gaussian blur and adding noise. Using our MLwG method, we then sample from the posterior distribution and compute the reconstructed image.

We compare different smoothing parameters to observe their effects on the reconstruction quality. Our results indicate that by adjusting the smoothing parameter, we can achieve better image quality and reduce artifacts.

Acceptance Rates and Convergence

To further assess the performance of the MLwG method, we examine the acceptance rates of the proposed samples and the convergence of the Markov chain. We demonstrate that the acceptance rates remain stable across different dimensions, reinforcing the efficiency of our proposed method.

Comparison with MALA

We also compare the performance of our MLwG method with that of the MALA algorithm. In these experiments, we observe that MLwG consistently achieves higher effective sample sizes, indicating better sampling performance and more accurate reconstruction results.

The results reveal that as we increase the dimensions, the benefits of the MLwG algorithm become more pronounced. MLwG allows for larger step sizes, speeding up convergence and reducing correlation among samples.

Conclusion

In this article, we have introduced a novel method for image deblurring using the MLwG algorithm. By combining Bayesian inference with efficient sampling techniques, we can effectively tackle the challenges posed by high-dimensional image data.

Our approach highlights the importance of considering the structure of the posterior distribution when designing sampling methods. By leveraging this structure, we can achieve dimension-independent performance, leading to more reliable and accurate reconstructions of blurred images.

Through numerical experiments, we have validated our theory and demonstrated the practical advantages of the MLwG algorithm over traditional methods like MALA. This work contributes to the ongoing efforts in image processing, particularly in areas where uncertainty quantification is critical, such as medical imaging and remote sensing.

Future work will focus on extending the framework to handle more complex noise models and exploring its application in various imaging tasks beyond deblurring.

Title: Local MALA-within-Gibbs for Bayesian image deblurring with total variation prior

Abstract: We consider Bayesian inference for image deblurring with total variation (TV) prior. Since the posterior is analytically intractable, we resort to Markov chain Monte Carlo (MCMC) methods. However, since most MCMC methods significantly deteriorate in high dimensions, they are not suitable to handle high resolution imaging problems. In this paper, we show how low-dimensional sampling can still be facilitated by exploiting the sparse conditional structure of the posterior. To this end, we make use of the local structures of the blurring operator and the TV prior by partitioning the image into rectangular blocks and employing a blocked Gibbs sampler with proposals stemming from the Metropolis-Hastings adjusted Langevin Algorithm (MALA). We prove that this MALA-within-Gibbs (MLwG) sampling algorithm has dimension-independent block acceptance rates and dimension-independent convergence rate. In order to apply the MALA proposals, we approximate the TV by a smoothed version, and show that the introduced approximation error is evenly distributed and dimension-independent. Since the posterior is a Gibbs density, we can use the Hammersley-Clifford Theorem to identify the posterior conditionals which only depend locally on the neighboring blocks. We outline computational strategies to evaluate the conditionals, which are the target densities in the Gibbs updates, locally and in parallel. In two numerical experiments, we validate the dimension-independent properties of the MLwG algorithm and demonstrate its superior performance over MALA.
